## Overview
This framework implements a two-stage reasoning pipeline that combines traditional machine learning with large language models (LLMs) to solve complex reasoning problems. The system achieves high accuracy by routing problems to specialized agents based on their category, each employing domain-specific reasoning strategies.
**Important Constraint**: Per challenge requirements, this system uses GPT-4o-mini (a lightweight model) rather than models with strong reasoning abilities (o1, o3, GPT-4, Claude Sonnet, etc.). This demonstrates that effective reasoning can be achieved through sophisticated system design and prompt engineering rather than relying solely on powerful models.
### Key Features

- **Two-Stage Pipeline**: Fast category classification followed by specialized reasoning
- **Chain-of-Thought Prompting**: Structured reasoning process for explainable AI
- **RESTful API**: Production-ready FastAPI interface with comprehensive documentation
- **Model Persistence**: Trained models cached for fast inference
- **Batch Processing**: Efficient handling of large test datasets
- **Confidence Scoring**: Probabilistic outputs with uncertainty quantification
## Problem Statement Coverage
This framework comprehensively addresses all requirements specified in the Machine Learning Challenge:
### 1. Multi-Category Reasoning Support

## Technical Implementation
### Stage 1: Category Classification
**Algorithm**: TF-IDF + Logistic Regression
**Rationale**:
- Fast inference (<50ms per sample)
- Interpretable feature importance
- No API costs for classification
- High accuracy with limited training data
- Robust to category variations
**Training Process**:
```python
1. Load training data (problem_statement, topic)
2. Split: 80% train, 20% validation (stratified)
3. Fit TF-IDF vectorizer on training text
4. Transform text to numerical features
5. Train multinomial logistic regression
6. Validate on held-out set
7. Save models to disk for reuse
```
**Feature Engineering**:
- Unigrams: "sequence", "pattern", "next"
- Bigrams: "next number", "spatial reasoning"
- Trigrams: "what is the next number"
- Sublinear TF: log(1 + TF) for better scaling
- IDF weighting: Emphasize discriminative terms
### Stage 2: Specialized Reasoning
**Algorithm**: LLM-based Chain-of-Thought
**Rationale**:
- Category-specific expertise
- Structured reasoning process
- Explainable outputs
- High accuracy on complex problems
**Prompt Design Principles**:
1. **Role Assignment**: Establish domain expertise
```
"You are an expert in [category]."
```
2. **Problem Presentation**: Clear formatting
```
Problem: {problem}
Options: 1. {opt1} ... 5. {opt5}
```
3. **Reasoning Framework**: Step-by-step guide
```
Solve this step-by-step:
1. [Category-specific step 1]
2. [Category-specific step 2]
...
```
4. **Pitfall Warnings**: Common mistakes
```
Be careful of:
- [Common error 1]
- [Common error 2]
```
5. **Output Structure**: Consistent format
```
REASONING: [explanation]
ANSWER: [1-5]
CONFIDENCE: [0.0-1.0]
```
**Response Parsing**:
- Regex-based extraction of structured fields
- Fallback mechanisms for malformed outputs
- Confidence calibration based on response quality
### Model Selection
**GPT-4o-mini**:
- Lightweight and cost-effective model
- Compliant with challenge constraints (no strong reasoning models)
- Demonstrates effectiveness of prompt engineering over raw model power
- Excellent instruction following capabilities
- Cost: ~$0.001-0.002 per problem (50x cheaper than GPT-4)
**Why GPT-4o-mini?**
The challenge explicitly prohibits the use of models with strong reasoning abilities (o1, o3, GPT-4, Claude Sonnet, etc.). This constraint forces the system to rely on:
- Sophisticated prompt engineering
- Category-specific reasoning templates
- Multi-stage architecture design
- Explicit chain-of-thought guidance
This approach proves that effective reasoning systems can be built with smaller models through proper system design rather than brute-force model capability.
**Configuration** (`config.py`):
```python
GPT_MODEL = "gpt-4o-mini"
TEMPERATURE = 0.1 # Low for consistency
```

## Future Extensions
The current system provides a solid foundation for advanced reasoning capabilities. The following extensions are planned for production deployment:
### 1. Advanced Reasoning Frameworks
**Purpose**: Evolve from simple chain-of-thought to sophisticated multi-agent reasoning architectures
**Current Limitation**: The system currently uses single-agent chain-of-thought prompting, which processes problems linearly through one specialized agent per category. While effective, this approach lacks the parallel exploration and consensus-building capabilities of modern reasoning frameworks.
**Next-Generation Frameworks**:
| Framework | Description | Key Advantages | Use Case |
|-----------|-------------|----------------|----------|
| **Fleet of Agents** | Multiple specialized agents work in parallel on the same problem, with a coordinator agent synthesizing their insights | Diverse perspectives, error correction through consensus, robust to individual agent failures | Complex multi-domain problems requiring expertise from multiple categories |
| **Tree of Thoughts (ToT)** | Explores multiple reasoning paths simultaneously in a tree structure, backtracking when needed | Systematic exploration of solution space, identifies dead-ends early, finds optimal solutions | Problems with multiple valid approaches or requiring search |
| **Graph of Thoughts (GoT)** | Represents reasoning as a graph with interconnected thought nodes, enabling non-linear reasoning | Handles complex dependencies, iterative refinement, combines intermediate results | Problems requiring synthesis of multiple sub-solutions |
| **ReAct (Reasoning + Acting)** | Interleaves reasoning steps with external actions (tool use, information retrieval) | Grounds reasoning in real data, adaptive strategy, reduces hallucination | Problems requiring external knowledge or computation |
| **Self-Refine** | Iterative self-critique and refinement of initial solutions | Progressive quality improvement, self-correction, confidence calibration | High-stakes problems requiring verification |
| **Reflexion** | Learns from past mistakes through episodic memory and self-reflection | Continuous improvement, error pattern recognition, adaptive strategies | Scenarios with repeated similar problems |
**Implementation Roadmap**:
```python
# Phase 1: Fleet of Agents Architecture
class FleetCoordinator:
def __init__(self):
self.specialist_agents = [
SpatialAgent(), SequenceAgent(), LogicAgent(), ...
]
self.coordinator = CoordinatorAgent()
def solve_with_fleet(self, problem: str, options: list) -> dict:
# Step 1: Parallel exploration
solutions = []
for agent in self.specialist_agents:
solution = agent.solve(problem, options)
solutions.append(solution)
# Step 2: Cross-agent deliberation
debates = self.facilitate_debate(solutions)
# Step 3: Consensus building
final_solution = self.coordinator.synthesize(
solutions=solutions,
debates=debates,
confidence_threshold=0.8
)
return final_solution
# Phase 2: Tree of Thoughts Integration
class TreeOfThoughtsReasoner:
def explore_reasoning_tree(self, problem: str, depth: int = 3):
# Generate multiple reasoning branches
branches = self.generate_branches(problem, branching_factor=3)
# Evaluate each branch
for branch in branches:
score = self.evaluate_branch(branch)
if score < threshold:
continue # Prune poor branches
# Recursively explore promising branches
if depth > 0:
sub_branches = self.explore_reasoning_tree(branch, depth-1)
branch.children = sub_branches
# Select best path
return self.select_optimal_path(branches)
# Phase 3: ReAct Integration with Tool Use
class ReActAgent:
def solve_with_tools(self, problem: str):
thought = self.think(problem)
while not self.is_complete(thought):
# Decide on action
action = self.decide_action(thought)
# Execute action (call external tool)
if action.type == "code_execution":
result = self.execute_code(action.code)
elif action.type == "symbolic_solver":
result = self.solve_symbolically(action.constraints)
# Update reasoning with action result
thought = self.integrate_result(thought, result)
return self.extract_answer(thought)
```
**Performance Improvements Expected**:
- **Accuracy**: +5-10% through consensus and error correction
- **Robustness**: 2-3x reduction in catastrophic failures
- **Explainability**: Multi-perspective reasoning traces
- **Confidence Calibration**: Better uncertainty quantification through agent agreement
**Migration Strategy**:
1. **Hybrid Mode**: Run both chain-of-thought and fleet in parallel, compare results
2. **Gradual Rollout**: Start with high-confidence CoT predictions, use fleet for uncertain cases
3. **A/B Testing**: Measure accuracy improvements across categories
4. **Full Migration**: Replace CoT once fleet consistently outperforms by >5%
**Challenges**:
- Increased API costs (3-5x more LLM calls)
- Higher latency (parallel calls + coordination overhead)
- Complexity in debugging multi-agent interactions
- Coordination logic development and tuning
**Mitigation**:
- Smart agent selection (not all agents for every problem)
- Asynchronous parallel execution
- Caching of intermediate reasoning steps
- Hierarchical coordination (only escalate to fleet for complex problems)
### 2. Symbolic Solver Integration
**Purpose**: Handle mathematical and logical problems with symbolic computation
**Technology Stack**:
| Tool | Purpose | Advantages | Limitations |
|------|---------|------------|-------------|
| **SymPy** | Symbolic mathematics in Python | Python-native, extensive documentation, algebraic manipulation | Limited to symbolic math |
| **Z3** | SMT (Satisfiability Modulo Theories) solver | Constraint solving, theorem proving, verification | Steep learning curve |
| **SageMath** | Comprehensive math software | Integrates 100+ open-source packages | Heavy installation |
| **MiniZinc** | Constraint modeling | Declarative syntax, optimization focus | Domain-specific language |
**Implementation Plan**:
```python
# Stage 1: Detect problem type
if category == "Logical traps" and contains_constraints(problem):
# Stage 2a: Convert to SMT-LIB format
constraints = extract_constraints(problem)
# Stage 2b: Solve with Z3
from z3 import Solver, Int, Bool
solver = Solver()
solver.add(constraints)
if solver.check() == sat:
model = solver.model()
return interpret_solution(model)
```
**Benefits**:
- Guaranteed correctness for solvable problems
- Proof generation for verification
- Handle infinite domains
- Detect unsatisfiable constraints
### 2. Code Execution Engine
**Purpose**: Enable dynamic code generation and execution for computational problems
**Technology Stack**:
| Tool | Purpose | Advantages | Limitations |
|------|---------|------------|-------------|
| **Piston API** | Remote code execution | Secure sandboxing, 40+ languages, containerized | External dependency, network latency |
**Architecture**:
```
Problem → LLM generates code → Piston API executes → Result validation → Answer
```
**Implementation**:
```python
import requests
def execute_code(code: str, language: str = "python"):
"""Execute code safely via Piston API"""
response = requests.post(
'https://emkc.org/api/v2/piston/execute',
json={
'language': language,
'version': '*',
'files': [{'content': code}],
'stdin': '',
'args': [],
'compile_timeout': 10000,
'run_timeout': 3000,
'compile_memory_limit': -1,
'run_memory_limit': -1
}
)
return response.json()['run']['output']
```
**Use Cases**:

### 3. Database Layer
**Purpose**: Persistent storage for results, caching, and analytics
**Technology Stack**:
| Tool | Purpose | Advantages | Limitations |
|------|---------|------------|-------------|
| **SQLite** | Relational database | Lightweight, serverless, perfect for single-instance | No concurrent writes, limited scalability |
| **Redis** | In-memory cache | Sub-millisecond latency, pub/sub, TTL support | Volatile (requires persistence config) |
**Schema Design**:
```sql
-- SQLite Schema
CREATE TABLE reasoning_cache (
id INTEGER PRIMARY KEY,
problem_hash TEXT UNIQUE NOT NULL,
problem_text TEXT NOT NULL,
category TEXT NOT NULL,
predicted_answer INTEGER NOT NULL,
confidence REAL NOT NULL,
reasoning TEXT NOT NULL,
timestamp DATETIME DEFAULT CURRENT_TIMESTAMP,
INDEX idx_hash (problem_hash),
INDEX idx_category (category)
);
CREATE TABLE category_stats (
category TEXT PRIMARY KEY,
total_count INTEGER DEFAULT 0,
avg_confidence REAL DEFAULT 0.0,
accuracy REAL DEFAULT 0.0
);
```
**Redis Caching Strategy**:
```python
import redis
import hashlib
import json
redis_client = redis.Redis(host='localhost', port=6379, db=0)
def get_cached_result(problem: str) -> dict:
"""Retrieve cached result if available"""
problem_hash = hashlib.md5(problem.encode()).hexdigest()
cached = redis_client.get(f"problem:{problem_hash}")
if cached:
return json.loads(cached)
return None
def cache_result(problem: str, result: dict, ttl: int = 86400):
"""Cache result with TTL (default 24 hours)"""
problem_hash = hashlib.md5(problem.encode()).hexdigest()
redis_client.setex(
f"problem:{problem_hash}",
ttl,
json.dumps(result)
)
```
**Benefits**:

### 4. Ensemble Methods
**Purpose**: Combine multiple reasoning strategies for improved accuracy
**Techniques**:
- **Majority Vote**: Multiple agents vote, select most common answer
- **Confidence Weighting**: Weight answers by agent confidence scores
- **Unanimous Consensus**: Only accept answers all agents agree on
- **Stacking**: Train meta-model on agent outputs
**Implementation**:
```python
def ensemble_solve(problem: str, options: dict) -> dict:
"""Solve using ensemble of multiple agents"""
# Get predictions from all agents
predictions = []
for agent in all_agents:
pred = agent.solve(problem, options)
predictions.append(pred)
# Confidence-weighted voting
weighted_votes = {}
for pred in predictions:
answer = pred['final_answer']
confidence = pred['confidence']
weighted_votes[answer] = weighted_votes.get(answer, 0) + confidence
# Select answer with highest weighted vote
final_answer = max(weighted_votes, key=weighted_votes.get)
return {
'final_answer': final_answer,
'confidence': weighted_votes[final_answer] / len(predictions),
'individual_predictions': predictions
}
```
### 5. Active Learning Pipeline
**Purpose**: Continuously improve system with human feedback
**Workflow**:
```
1. System makes prediction with low confidence (<0.6)
2. Flag for human review
3. Human provides correct answer + explanation
4. Update training data
5. Retrain category classifier
6. Fine-tune prompts based on error patterns
```
**Implementation**:
```python
class ActiveLearningQueue:
def __init__(self, confidence_threshold=0.6):
self.threshold = confidence_threshold
self.review_queue = []
def should_review(self, result: dict) -> bool:
return result['confidence'] < self.threshold
def add_to_queue(self, problem: str, result: dict):
self.review_queue.append({
'problem': problem,
'prediction': result,
'timestamp': datetime.now()
})
def process_feedback(self, problem_id: int, correct_answer: int, explanation: str):
# Add to training data
new_training_example = {
'problem': self.review_queue[problem_id]['problem'],
'correct_answer': correct_answer,
'explanation': explanation
}
# Retrain models
self.retrain_pipeline(new_training_example)
```python
CATEGORY_PROMPTS["New Category"] = """
You are an expert in [domain].
Problem: {problem}
Answer Options:
1. {option_1}
...
Solve this step-by-step:
1. [Custom reasoning step 1]
2. [Custom reasoning step 2]
...
Be careful of:
- [Common pitfall 1]
- [Common pitfall 2]
Provide your reasoning and select the correct option (1-5).
"""
```
